Mr. Johnson was a rugby player at school and was often jogged, albeit sometimes in a pair of formal leather shoes.
He was also filmed playing tennis, while a source close to him said he was “not a big drinker.”
The latest exchange came after Mr Johnson and Mr Wallace criticized Putin for being “macho” and “lunatic”.
The prime minister said on Tuesday: “If Putin was a woman, which obviously is not… but if she was, I really don’t think he would embark on a crazy macho war, an invasion of violence, on the road that he has.
“If you want a perfect example of toxic masculinity, this is what he does in Ukraine.
Asked in a separate interview if he considered Putin evil, the prime minister replied: “I think it probably follows that if you are what you do, then for sure. It was a horrific act of unwarranted aggression against the innocent population [of Ukraine]”
Mr Wallace, who previously accused Putin of invading Ukraine, doubled the prime minister’s comments and said the Russian leader, who is five feet tall, suffers from “little man syndrome”.
He told LBC: “I certainly think Putin’s view of himself and the world is a syndrome of the little man, macho. You rarely hear the expression “little woman’s syndrome” and he understands it in spades.
